Title:Image Reconstruction Using a Mixture Score Function (MSF)
View PDFAbstract:Computed tomography (CT) reconstructs volumetric images using X-ray projection data acquired from multiple angles around an object. For low-dose or sparse-view scans, the classic image reconstruction algorithms often produce severe noise and artifacts. To address this issue, we develop an iterative image reconstruction method based on maximum a posteriori (MAP) estimation. In the Bayesian framework, the gradient of logarithmic probability density distribution of the image, i.e., the score function, plays a crucial role, contributing to the process of image reconstruction. By leveraging Gaussian mixture model, we derive a novel score matching formula to establish a mixture score function (MSF) through deep learning. The MSF-based iterative reconstruction algorithm significantly improves image reconstruction quality. The convergence of the MSF iterative reconstruction algorithm is first proven through mathematical analysis. Then, the performance of the MSF reconstruction method is evaluated on both public medical image datasets and clinical raw CT dataset. Our results show that our proposed method outperforms state-of-the-art reconstruction methods in terms of accuracy and generalizability.
